    Abstract: Increasingly, organizations are looking beyond conventional data provided by data aggregators and vendors in their industry. But alternative data, because of the way it’s generated and collected, is typically noisy and often ephemeral. A model’s ability to learn and correctly predict future outcomes is greatly influenced by the underlying data. Clean, complete data can make the difference between deriving correct and incorrect conclusions. Incomplete data can restrict its application to only a small set of techniques. And for alternative data sources, missed data is almost impossible to recover. Anjali Samani (CircleUp) explains two simple frameworks for evaluating a dataset’s candidacy for smoothing and quantitatively determining the optimal imputation strategy and the number of consecutive missing values that can be imputed without material degradation in signal quality. To extract meaningful signals from alternative data, it’s necessary to apply denoising and imputation to generate clean and complete time series. There are numerous ways to smooth a noisy data series and impute missing values, each with relative strengths and weaknesses. Smoothing removes noise from the data and allows patterns and trends to be identified more easily. It can, however, make a series appear less volatile than it is and may mask the very patterns you’re seeking to identify. So you have to know when you should and shouldn’t smooth a series, and if it is smoothed, what type of smoothing you should apply. Similarly, missing observations in time series can be imputed in many ways. These are covered in detail in both academic and practitioner literature. What caused the missing values in the first place and how the data is going to be used in downstream applications can often inform the most appropriate strategy for imputation. However, when there are multiple options to choose from, you have to objectively choose between different strategies and identify how many consecutive missing values can be safely imputed. James Terwilliger, Badrish Chandramouli, and Jonathan Goldstein explore the history of decades of streaming data processing at Microsoft: a beginning in research, a first product in StreamInsight, the transition to the cloud, and all the pain points along the way. A key result of that lineage and learning has been the Trill engine, which has three key properties a single standalone data processing engine for all temporal data, no matter if the data is streamed or stored; a simple API that integrates seamlessly with the programming language; and performance without ego, a willingness to use every lesson learned to improve throughput in every way possible. They dive deep into why each of those properties is important through examples. A simple application to demonstrate the basics of Trill: joins, aggregation, windowing; a more complicated application to demonstrate the power of Trill’s API: progressive windowing, regular expressions and pattern detection, data-dependent windows; and an overview of the kind of query used by Bing Ads, a query to run a multi-billion-dollar business. You’ll see a performance showcase: running the previous examples to demonstrate how Trill got its name—processing a trillion events per day on a single node. For DoorDash, which focuses on food delivery, this problem is even more difficult because of its three-sided marketplace, where the company must identify the optimal Dasher to fulfill a delivery from a restaurant and bring it to a consumer. At its core, this marketplace logistics problem is a core operations research problem called the vehicle routing problem. But DoorDash faces additional challenges: delivery requests come in in real time; most orders need to be delivered immediately; Dashers are in constant movement; and the effects of variance in restaurant operations and real-world events (traffic, weather, etc.) have pronounced effects on the solutions. Thus, finding global optimality in real time becomes intractable. To address these challenges, DoorDash leverages various AI techniques to intelligently model the decision space and achieve near-optimal solutions in seconds. You’ll get a first look at scalable graph convolutional neural networks for forensic analysis of financial data, which is massive, dense, and dynamic. Mark outlines preliminary experimental results using a large synthetic graph (1M nodes, 9M edges) generated by a data simulator called AMLSim, and he considers opportunities for high performance efficiency, in terms of computation and memory, and shares results from a simple graph compression experiment, all of which supports the working hypothesis that graph deep learning for AML bears great promise in the fight against criminal financial activity.
