It has now been open-sourced and is available to everyone. But it has been a long path to get there. James Terwilliger, Badrish Chandramouli, and Jonathan Goldstein explore the history of decades of streaming data processing at Microsoft: a beginning in research, a first product in StreamInsight, the transition to the cloud, and all the pain points along the way. A key result of that lineage and learning has been the Trill engine, which has three key properties a single standalone data processing engine for all temporal data, no matter if the data is streamed or stored; a simple API that integrates seamlessly with the programming language; and performance without ego, a willingness to use every lesson learned to improve throughput in every way possible. They dive deep into why each of those properties is important through examples. A simple application to demonstrate the basics of Trill: joins, aggregation, windowing; a more complicated application to demonstrate the power of Trill’s API: progressive windowing, regular expressions and pattern detection, data-dependent windows; and an overview of the kind of query used by Bing Ads, a query to run a multi-billion-dollar business. You’ll see a performance showcase: running the previous examples to demonstrate how Trill got its name—processing a trillion events per day on a single node. And that difference can be crucial in some ML tasks, such as when ML models are trained using sensitive data. Recently, new techniques have emerged for differentially private training of ML models, including deep neural networks (DNNs), that used modified stochastic gradient descent to provide strong privacy guarantees for training data. This said, they come with their own set of hyperparameters that need to be tuned, and they necessarily make learning less sensitive to outlier data in ways that are likely to slightly reduce utility. For DoorDash, which focuses on food delivery, this problem is even more difficult because of its three-sided marketplace, where the company must identify the optimal Dasher to fulfill a delivery from a restaurant and bring it to a consumer. At its core, this marketplace logistics problem is a core operations research problem called the vehicle routing problem. But DoorDash faces additional challenges: delivery requests come in in real time; most orders need to be delivered immediately; Dashers are in constant movement; and the effects of variance in restaurant operations and real-world events (traffic, weather, etc.) have pronounced effects on the solutions. Thus, finding global optimality in real time becomes intractable. To address these challenges, DoorDash leverages various AI techniques to intelligently model the decision space and achieve near-optimal solutions in seconds.     Abstract: At MakeMyTrip, a large number of customer care agents were dedicated to handling customer support issues over voice and email. Given the popularity of WhatsApp in India, conversational interfaces have become mainstream for the Indian consumer. MakeMyTrip decided to capitalize on this trend and revamped customer support channels using a chatbot named Myra. Myra is adept at handling the languages of the Indian consumer including English, Hindi, and a mix of the two popularly known as Hinglish. Madhu Gopinathan and Sanjay Mohan explain the high-level architecture and the business impact Myra created. Myra handles user input using a natural language understanding framework that solves problems such as intent classification and slot extraction using the latest advances in deep learning. In the intent classification problem, “Please cancel my ticket” should be mapped to a label "full cancellation.” The intent classification model supports over 120 intents and is sophisticated enough to distinguish between fine-grained intents such as full cancellation, partial cancellation, and flight cancellation by airlines. In the slot extraction problem, from, “Please cancel my ticket to New York,” the value, “New York” should be extracted to fill the destination slot. For curating the data required for training deep learning models, MakeMyTrip employed multiple methods, such as manual tagging, creating language models from existing email conversations, progressive refinement of the models, and natural language generation. In this case study, Madhu and Sanjay dive into the insights from developing deep learning models to power Myra, revamping of agent tools, and processes to support Myra and the ensuing business impact.     Abstract: When you access a web page, bidders such as Criteo must determine in a few dozens of milliseconds if they want to purchase the advertising space on the page. At that moment, a real-time auction takes place, and once you remove all the communication exchange delays, it leaves a handful of milliseconds to compute exactly how much to bid. In the past year, Criteo has put a large amount of effort into reshaping its in-house machine learning stack responsible for making such predictions—in particular, opening it to new technologies such as TensorFlow. Unfortunately, even for simple logistic regression models and small neural networks, Criteo’s initial TensorFlow implementations saw inference time increase by 100, going from 300 microseconds to 30 milliseconds. Nicolas Kowalski and Axel Antoniotti outline how Criteo approached this issue, discussing how Criteo profiled its model to understand its bottleneck; why commonly shared solutions such as optimizing TensorFlow build for the target hardware, freezing and cleaning up the model, and using accelerated linear algebra (XLA) ended up being lackluster; and how Criteo rewrote is models from scratch, reimplementing cross-features and hashing functions using low-level TF operations in order to factorize as much as possible all TensorFlow nodes in its model.     Abstract: Streaming analytics (or fast data processing) is becoming an increasingly popular subject in enterprise organizations. Customers want real-time experiences, such as notifications and advice based on their online behavior and other users’ actions. A typical streaming analytics solution follows a “pipes and filters” pattern that consists of three main steps: detecting patterns on raw event data (complex event processing), evaluating outcomes with the aid of business rules and machine learning algorithms, and deciding on the next action. At the core of this architecture is the execution of predictive models that operate on enormous amounts of never-ending data streams. Bas Geerdink (Aizonic) presents an architecture for streaming analytics solutions that covers many use cases that follow this pattern: actionable insights, fraud detection, log parsing, traffic analysis, factory data, the IoT, and others. He explores a few architecture challenges that arise when dealing with streaming data, such as latency issues, event time versus server time, and exactly once processing. The solution is open source and available on GitHub: build on the KISSS stack.     Abstract: With the fundamental breakthroughs in artificial intelligence and the significant increase of digital healthcare data, there’s been enormous interest in AI for healthcare applications. One rapidly developing area is the use of deep neural networks for medical imaging, with applications ranging from diagnosing chest X-rays to the early detection of Alzheimer’s to identifying cancer in pathology slides. Despite this variety of applications, there remain some crucial unanswered questions. On the methods side, there’s been a premature convergence on a specific model-development strategy: deep neural networks are first trained on natural image data, and then fine-tuned (transferred) to work on the medical data. Maithra Raghu (Cornell University Google Brain) explores this process and shows that contrary to conventional wisdom, this standard method of model development isn’t guaranteed to provide the benefits it’s believed to, and she suggests simple and effective alternate methodologies. On the applications side, there’s been little exploration of the interaction of these medical AI algorithms with human experts, with existing literature typically evaluating the algorithm in isolation and the human experts in isolation—vastly different from a realistic deployment scenario. Maithra examines the essential question—the role of human experts—which provides new, crucial prediction problems to study and significant benefits through the effective combination of artificial and human intelligence. Kerrie holds a number of technology patents and is the author of Is Your Company Ready for Cloud, 100 SOA Questions: Asked and Answered, and AI-First Healthcare (cowritten with UHG’s Siupo Becker). He holds a BA in mathematics from DePaul University in Chicago as well as a JD and an honorary degree, doctor of humane letters.

    Abstract: Training deep neural network models requires a highly tuned system with the right combination of software, drivers, compute, memory, network, and storage resources. Deep learning frameworks like TensorFlow, PyTorch, Caffe, Torch, Theano, and MXNet have contributed to the popularity of deep learning by reducing the effort and skill needed to design, train, and use deep learning models. Fabric for Deep Learning (FfDL, pronounced “fiddle”) provides a consistent way to run these deep learning frameworks as a service on Kubernetes. FfDL uses a microservices architecture to reduce coupling between components, keep each component simple and as stateless as possible, isolate component failures, and allow each component to be developed, tested, deployed, scaled, and upgraded independently. Animesh Singh, Atin Sood, and Tommy Li share lessons learned while building and using FfDL and demonstrate how to leverage it to execute distributed deep learning training for models written using multiple frameworks, using GPUs and object storage constructs. They then explain how to take models from IBM’s Model Asset Exchange, train them using FfDL, and deploy them on Kubernetes for serving and inferencing. This session is sponsored by IBM.
